I have shipped five AI-powered products in the last 18 months as a solo developer: a document analysis tool, a code review automation service, an AI writing assistant for legal professionals, a technical documentation generator, and a developer tool for AI API cost monitoring. Two are profitable and growing. Two were shut down after failing to find traction. One is still running but not yet covering its costs. These are the twelve lessons that would have saved me significant time, money, and frustration had I known them before I started.
Lesson 1: The API is not the moat
Every AI product I built started with the assumption that using a better or cheaper underlying model was a meaningful competitive advantage. It is not. The underlying model is a commodity input that anyone can access. The moat is in distribution, customer relationships, workflow integration, and proprietary data — the same sources of competitive advantage that matter in any software business. Build around the model, not on it.
Lesson 2: Prompt engineering does not scale
Three of my five products relied heavily on carefully crafted prompts that worked well in testing and broke in ways I did not anticipate in production. User inputs in production are messier, more diverse, and more adversarial than testing scenarios reveal. Products that require prompt perfection to deliver value are brittle. Products that handle imperfect inputs gracefully — through validation, fallbacks, and human escalation paths — are more defensible.
Lesson 3: Latency is a product problem, not a technical problem
My code review automation service failed partly because it took 15-30 seconds to generate a review. The capability was good; the experience was not. Developers have been conditioned to expect near-instant feedback from their tooling. Any AI feature that adds perceptible latency to an existing workflow needs to compensate with substantially better output than the fast alternative. Streaming, progress indicators, and parallel processing help at the margins but do not eliminate the fundamental problem if the core latency is too high.
Lesson 4: Spend on actual users before spending on infrastructure
I spent two months building a robust multi-tenant infrastructure for my legal writing assistant before finding out through user interviews that lawyers do not want cloud-hosted AI tools processing client documents, regardless of privacy guarantees. The product needed to be deployable on-premise. Two months of infrastructure work became technical debt that I eventually deleted. Find five customers willing to pay before writing serious infrastructure code.
Lesson 5: Cost management is a first-class product requirement
AI API costs scale with usage in ways that create existential problems for products that gain unexpected traction. My documentation generator briefly went viral on Twitter and generated 2,000 sign-ups in 48 hours — along with $800 in unexpected API costs. Implement usage limits, cost monitoring alerts, and cost-based feature gating before you have users, not after you have a surprise bill.
Lesson 6: Fine-tuning beats prompt engineering for consistent outputs
For my two profitable products, the turning point was fine-tuning smaller models on domain-specific examples rather than continuing to refine prompts for frontier models. A fine-tuned 7B model on 500 domain-specific examples consistently outperformed my best prompts with GPT-4 on the specific task, at 15% of the API cost. The investment in fine-tuning pays back quickly at any meaningful usage volume.
Lesson 7: Human escalation is not a failure mode — it is a feature
The most user-positive design decision I made was building explicit “I’m not confident about this, please review” outputs into my products. Users trust AI tools more when the tools acknowledge uncertainty rather than presenting low-confidence outputs with the same confidence as high-quality outputs. The escalation path also captures the edge cases your model handles poorly, generating training data to improve future versions.
Lesson 8: The demo gap is real and it matters
Every AI product I built worked impressively well on the demos I chose to show investors and early users. Every AI product also had edge cases where it performed embarrassingly badly. Managing the gap between demo performance and average performance is a product problem that requires investment in input validation, edge case detection, and graceful degradation — not just model improvement.
Lesson 9: Distribution beats capability
My technically worst product (by model quality metrics) is my most commercially successful one. It integrates into a workflow that 50,000 developers use daily, delivers 80% good-enough outputs on the most common use cases, and charges a monthly subscription that most users barely think about. The technically superior products that required users to change their workflow struggled to grow. Integration is distribution.
Lesson 10: Observability is not optional
You cannot improve what you cannot measure. Logging every model input, output, latency, cost, and user action is essential for understanding how your product actually performs in production. The products where I invested early in observability improved faster and avoided more production incidents than the products where I bolted on monitoring after seeing problems. Treat model observability with the same seriousness as application observability.
Lesson 11: Privacy concerns are technical requirements
In every enterprise sales conversation, data privacy came up before pricing. Organizations considering AI tools that process their data have legitimate questions about where data goes, who has access, how long it is retained, and what it might be used for. Having clear, documented answers to these questions — and ideally technical controls (on-premise deployment option, data deletion APIs, audit logs) — is a prerequisite for enterprise sales, not a nice-to-have.
Lesson 12: The model is the least durable part of your product
The models your product is built on today will be replaced by better, cheaper models within 12-18 months. The switching cost between models is real but manageable if you design for it from the start: abstract the model layer behind a clean interface, evaluate new models systematically as they release, and plan for model migration as a routine operational task rather than an emergency engineering project.
Shipping AI products solo is more achievable than it was 24 months ago and more competitive than it was 12 months ago. The tooling is better, the models are more capable, and the market appetite is real. The products that succeed are built on customer insight, not model novelty — the same principle that has always separated successful software from technically impressive software that nobody uses.
